  1. 抓取 Karpathy 官方博客索引 https://karpathy.github.io/ ,确认其在个人博客上的文章清单(Deep RL: Pong from Pixels、Policy Gradient、Hackers' Guide、RNN effectiveness、RNN irregular data、Bayes 等);
  2. Web 搜索「Karpathy best classic blog posts」,外部共识指向四篇 canonical 经典:RNN effectiveness(2015)、Yes you should understand backprop(2016)、Software 2.0(2017)、A Recipe for Training Neural Networks(2019)(后者在 https://karpathy.github.io/2019/04/25/recipe/ );

1. 《The Unreasonable Effectiveness of Recurrent Neural Networks》(2015-05-21)

"We'll train RNNs to generate text character by character and ponder the question 'how is that even possible?'"

"If training vanilla neural nets is optimization over functions, training recurrent nets is optimization over programs."

他先论证 RNN 本质上描述程序("Viewed this way, RNNs essentially describe programs."),提到 RNN 是图灵完备的,随后立刻自嘲:"In fact, forget I said anything."(其实,就当我没说过——提醒读者别像过度解读万能逼近定理那样过度解读它。)

"the common wisdom was that RNNs were supposed to be difficult to train (with more experience I've in fact reached the opposite conclusion)."
"At the core, RNNs have a deceptively simple API: They accept an input vector x and give you an output vector y."

普通网络的局限被他概括为 "A glaring limitation of Vanilla Neural Networks ... is that their API is too constrained: they accept a fixed-sized vector as input and produce a fixed-sized vector as output."

"The concept of attention is the most interesting recent architectural innovation in neural networks."

Paul Graham 文集~1MB(约 100 万字符)2 层 LSTM、512 hidden、~350 万参数、dropout 0.5、batch 100、BPTT 100,TITAN Z 上 0.46s/batch学会英语拼写与创业黑话,甚至 "learns to support its own arguments (e.g. [2], above)"(自己编引用编号)
I can barely recognize these samples from actual Shakespeare"
URL——"the model just hallucinated it"(2015 年就在演示幻觉!)
代数几何 LaTeX16MB多层 LSTM"the resulting sampled Latex almost compiles"(几乎能编译)

"Topics and themes that span multiple words (and in general longer-term dependencies) start to emerge only much later."

"one of its cells gradually tuned itself during training to become a quote detection cell, since this helps it better perform the final task. This is one of the cleanest and most compelling examples of where the power in Deep Learning models (and more generally end-to-end training) is coming from."

"You can confidently expect a large amount of innovation in the space of RNNs, and I believe they will become a pervasive and critical component to intelligent systems."

文章结尾是著名的行为艺术:用这篇博客自己(仅 46K 字符)训练了一个 RNN,生成的乱码恰好是 "I've the RNN with and works, but the computed with program of the RNN with...",他写道 "Yes, the post was about RNN and how well it works, so clearly this works :)."

2. 《Software 2.0》(2017-11,Medium)

Karpathy 认为这个视角完全看错了大局("completely misses the forest for the trees")。

"Neural networks are not just another classifier, they represent the beginning of a fundamental shift in how we write software. They are Software 2.0."
    • Software 1.0:"written in languages such as Python, C++, etc. It consists of explicit instructions to the computer written by a programmer."(程序员逐行写下显式指令,每一行都是在程序空间中标定一个行为良好的点。)
    • Software 2.0:"Software 2.0 is written in neural network weights. No human is involved in writing this code because there are a lot of weights (typical networks might have millions), and coding directly in weights is kind of hard (I tried)."(我试过直接在权重里写代码,很难——这句自嘲极有 Karpathy 风格。)
    • 2.0 的编程方式:"we specify some constraints on the behavior of a desirable program (e.g., a dataset of input output pairs of examples) and use the computational resources at our disposal to search the program space for a program that satisfies the constraints."——给约束(数据),让算力在程序空间里搜出满足约束的程序;搜出过程的高效化靠 backprop + SGD("somewhat surprisingly" efficient)。
"it turns out that a large portion of real-world problems have the property that it is significantly easier to collect the data (or more generally, identify a desirable behavior) than to explicitly write the program."
"A large portion of programmers of tomorrow do not maintain complex software repositories, write intricate programs, or analyze their running times. They collect, clean, manipulate, label, analyze and visualize data that feeds neural networks."
"Software 2.0 is not going to replace 1.0 (indeed, a large amount of 1.0 infrastructure is needed for training and inference to 'compile' 2.0 code), but it is going to take over increasingly large portions of what Software 1.0 is responsible for today."

  1. Computationally homogeneous(计算同构)——"a sandwich of only two operations: matrix multiplication and thresholding at zero (ReLU)",只给极少数原语做正确性/性能保证即可;
  2. Simple to bake into silicon(易于铸进芯片)——预见 ASIC/神经形态芯片,并预言 "The world will change when low-powered intelligence becomes pervasive around us";
  3. Constant running time(运行时间恒定)——"zero variability based on the different execution paths your code could take through some sprawling C++ code base",且 "almost guaranteed to never find ourselves in unintended infinite loops";
  4. Constant memory use(内存用量恒定)——无动态分配、无内存泄漏;
  5. It is highly portable(高度可移植)——一串矩阵乘法在哪都能跑;
  6. It is very agile(极其敏捷)——"we can take our network, remove half of the channels, retrain, and there — it runs exactly at twice the speed and works a bit worse. It's magic."(砍一半通道重训即得双倍速度,反方向加数据/算力即得更强程序);
  7. Modules can meld into an optimal whole(模块可熔合为最优整体)——"if two Software 2.0 modules that were originally trained separately interact, we can easily backpropagate through the whole"(他做了一个惊人类比:想象浏览器能自动重新设计底层十层的系统指令来加速网页加载,在 2.0 里这是默认行为);
  8. It is better than you(它比你强)——"Finally, and most importantly, a neural network is a better piece of code than anything you or I can come up with in a large fraction of valuable verticals, which currently at the very least involve anything to do with images/video, sound/speech, and text."

  1. 难以解释——"we're left with large networks that work well, but it's very hard to tell how. Across many applications areas, we'll be left with a choice of using a 90% accurate model we understand, or 99% accurate model we don't."(90% 准确但可理解 vs 99% 准确但不可理解——这个两难今天仍是每个 AI 产品的核心决策。)
  2. 会以不直观且尴尬的方式失败——"or worse, they can 'silently fail', e.g., by silently adopting biases in their training data, which are very difficult to properly analyze and examine when their sizes are easily in the millions in most cases."(静默继承训练数据中的偏见。)
  3. 对抗样本——"the existence of adversarial examples and attacks highlights the unintuitive nature of this stack."

  1. 缺一个 IR:"in the 1.0 stack LLVM IR forms the middle layer ... With neural networks we're already seeing an explosion of front ends (PyTorch, TF, Chainer, mxnet, etc) and back ends (CPU, GPU, TPU?, IPU?, …), but what is a fitting IR, and how we can optimize it (Halide-like)?"——问出「神经网络的 LLVM IR 是什么」;
  2. 缺一个 2.0 的 IDE:"With Software 2.0 we don't write the code, but we do assemble datasets which imply the code through the optimization. Who is going to develop the first powerful Software 2.0 IDEs, which help us accumulate, visualize, clean, label, and source data? Perhaps the IDE bubbles up images that the network suspects are mislabeled..."(预见了数据标注/数据飞轮平台,甚至预见了「让模型挑出疑似错标样本」——这就是今天 active learning / LLM-as-judge 数据环流的雏形);
  3. AGI 之问:
"in the long term, the future of Software 2.0 is bright because it is increasingly clear to many that when we develop AGI, it will certainly be written in Software 2.0. And Software 3.0? That will be entirely up to the AGI."

3. 《Yes you should understand backprop》(2016-12,Medium)

"Why do we have to write the backward pass when frameworks in the real world, such as TensorFlow, compute them for you automatically?"

Karpathy 认为常见的辩护("it's worth knowing what's under the hood as an intellectual curiosity" / "you might want to improve on the core algorithm later")都不够硬,本文给出一个更硬的理由——反向传播是一个会漏的抽象(leaky abstraction),当黑盒用会付出现实代价。

"The problem with Backpropagation is that it is a leaky abstraction."
"it is easy to fall into the trap of abstracting away the learning process — believing that you can simply stack arbitrary layers together and backprop will 'magically make them work' on your data."

   z = 1/(1 + np.exp(-np.dot(W, x)))   # forward pass
   dx = np.dot(W.T, z*(1-z))           # backward pass: local gradient for x
   dW = np.outer(z*(1-z), x)           # backward pass: local gradient for W

权重初始化过大 → 矩阵乘输出范围极大(如 -400~400)→ sigmoid 输出趋近 0/1 → 局部梯度 z*(1-z) 归零 → 链式法则往后全零,"your training loss will be flat and refuse to go down"。

"its local gradient (z*(1-z)) achieves a maximum at 0.25, when z = 0.5. That means that every time the gradient signal flows through a sigmoid gate, its magnitude always diminishes by one quarter (or more)."
  1. 死 ReLU(Dying ReLUs):前向被钳到 0 的神经元,反向权重梯度恒为 0;初始化不幸或学习率过猛都会造成 "permanent, irrecoverable brain damage"(永久的、不可逆的脑损伤),并给出量化事实:"a large fraction (e.g. 40%) of your neurons were zero the entire time"(扫一遍训练集可能发现 40% 神经元从未激活过)。
This sequence either goes to zero if |b| < 1, or explodes to infinity when |b|>1. The same thing happens in the backward pass of an RNN, except b is a matrix and not just a number, so we have to reason about its largest eigenvalue instead."——所以要么梯度裁剪要么 LSTM。
"The clip_by_value function has a local gradient of zero outside of the range min_delta to max_delta, so whenever the delta is above min/max_delta, the gradient becomes exactly zero during backprop."

正确做法是用 Huber loss(文内给出 clipped_error 代码),因为"we can't meddle with the gradients directly"。"I submitted an issue on the DQN repo and this was promptly fixed."(提 issue 后被修复——全文最有说服力的一句证据。)

"Backpropagation is a leaky abstraction; it is a credit assignment scheme with non-trivial consequences. If you try to ignore how it works under the hood because 'TensorFlow automagically makes my networks learn', you will not be ready to wrestle with the dangers it presents, and you will be much less effective at building and debugging neural networks."

作者承认的:文末自嘲全文变成了 CS231n 广告("I'm aware that this post has (unintentionally!) turned into several CS231n ads. Apologies for that :)")。

主要主张① "training recurrent nets is optimization over programs"——字符级模型能从纯文本学出语法、结构与长程依赖,且 attention 是最重要的架构创新方向;② "Neural networks are not just another classifier, they represent the beginning of a fundamental shift in how we write software"——程序员的核心工作将从写代码迁移到整理数据,AGI 必然写成 Software 2.0;③ "The problem with Backpropagation is that it is a leaky abstraction"——不懂信用分配机制就无法高效构建和调试网络

  1. 从最小可复现实验出发(char-RNN 100 行 numpy;backprop 三行核心代码);
  2. 给原始样本而非结论(直接贴生成的文本/代码,让读者自己判断);
  3. 对称地列优势与局限(Software 2.0 的 8 vs 3;RNN 篇明说 RNN 会背不会推);
  4. 标注自己的不确定("slightly hand-wavy"、"forget I said anything");
